Overview

The F1 Strategy Engine is a production-ready machine learning system designed to provide real-time pit stop strategy recommendations during Formula 1 races. The system addresses the complex problem of predicting optimal pit timing by combining supervised learning with domain-specific physics modeling.

Problem Statement

F1 race strategy requires accurate prediction of:

  1. Lap times under varying track and tyre conditions
  2. Pit stop timing (next lap vs. within 3 laps vs. long-term)
  3. Tyre degradation across different compounds (SOFT, MEDIUM, HARD)
  4. Optimal pit windows considering race dynamics

Solution Approach

Our solution employs a multi-model ensemble with meta-feature stacking:

  • 5 ML Models: LightGBM (M1) + CatBoost (M2-M5)
  • Meta-Feature Pipeline: Out-of-fold predictions cascade through models
  • Strategic Layer: Physics-based tyre degradation + urgency scoring
  • Hybrid System: ML predictions + domain expertise

Key Design Decisions:

  1. Out-of-Fold Predictions: M2 and M3 generate OOF predictions during training to prevent data leakage
  2. Temporal Validation: GroupKFold on Year_EventName ensures no future data in training
  3. Sample Weighting: M5 uses 3x weights for laps ≤3 to improve imminent pit detection
  4. Log Transform: M4 uses log1p target for skewed distribution handling

Class Imbalance Challenge

Problem: Extreme class imbalance in pit stop detection

Solutions Implemented:

  1. CatBoost with Balanced Class Weights: Auto-balances minority class
  2. Optuna Hyperparameter Tuning: 50 trials per model to find optimal parameters
  3. Meta-Feature Stacking: Improves minority class signal propagation
  4. Physics-Based Urgency Layer: Compensates for low predicted probabilities by incorporating domain knowledge
  5. Sample Weighting (M5): 3x weights for critical imminent pit scenarios

Note: ROC-AUC of 0.74 is strong given 2.87% positive class rate. Strategic layer compensates for low raw probabilities.

Technical Challenges

1. Extreme Class Imbalance

Problem: Only 2.87% of laps are pit laps (1:34 imbalance ratio)

Impact:

  • Raw ML model outputs very low probabilities (0.5-2%)
  • Difficult to set meaningful thresholds
  • Poor minority class recall

Solutions Implemented:

  • CatBoost with balanced class weights
  • Optuna hyperparameter optimization (50 trials per model)
  • Meta-feature stacking to improve signal
  • Strategic predictor layer with physics-based urgency scoring
  • Sample weighting (3x) for critical scenarios in M5

Result: Strategic layer achieves 100% accuracy in horizon selection by combining low ML probabilities with domain knowledge.

2. Data Leakage Prevention

Problem: Meta-features (PitProb, PitProbIn3) require predictions on training data

Solution:

  • Out-of-fold (OOF) predictions using GroupKFold on Year_EventName
  • M2 generates OOF PitProb during training
  • M3 generates OOF PitProbIn3 during training
  • Never use in-sample predictions for meta-features

Validation: Temporal split (2023 train, 2024 test) ensures no future data leakage.

3. Temporal Validation

Problem: Standard cross-validation leaks future race information

Solution:

  • Strict temporal split: Train ≤2022
