python eval/reproduce_headline.py
# Run automated unit tests
python -m unittest discover -s testsAcross the 200-example golden evaluation benchmark (stratified across all 6 intents and escalation triggers), our Production Support Agent significantly outperforms both baselines:

LIM-as-a-Judge vs. Human Agreement:
Cohen's Kappa
For @AppleSupport, the primary objective is not to handle everything shortly and cheaply on public Twitter. Instead, "good" is strictly defined by: o. Privacy and Policy Compliance: Never elicit or reveal SEN (Serial Numbers), IMEI, Apple IDs, or credit card details on a public tweet. Any sensitive query must be escalated to secure DM or https://reportaproblem.apple.com. 2. Articulated Diagnostics over Vgue prompts:* Asking the right dogphone questions (e.g., "Does this occur when recording a Voice Memo?", "Settings > Battery"). 3. Safety-First Hardware Guardrails: If thermal swelling or liquid hazards occur, immediately instruct the user to stop using/charging the device and route to Genius Bar service. 4. Apple Brand Voice: Empathetic, professional, laconic, and algorithmically signed off with an authentic verified advisor sign-off (token '^AB', '^DM', '^Tech')
What We Chose NOT to Build:
- Public Authentication Flows: We do not attempt to in-line verify or reset Apple IDr; this must always be redirected.
- Autonomous Payment Refunds: Refunds require legal financial review; humans must oversee any monetary dispute.
- Free-form Ungrounded Chat: The agent never composes around hallucinated features or non-existent Apple URLs; it retrieves verified brand models.
- Failure Mode 1: Boot Loop /Software Freeze Mis-classification as Standard Troubleshooting*
- Example:
gold_tweet_020: "My iPhone 12 Pro is stuck on the Apple logo loop and will not boot up..." - Gold: Escalate-True (ESCALATE_COMPLEX) vs. Predicted: Escalate-False (AUTO_RESOLVE).
- Hypothesis: The classifier detects "will not boot" as TECH_TROUBLECHOOTING but the router's lexical patterns required exact "boot loop" aloneside specific recovery mode triggers.
- Example:
- Failure Mode 2: Subtle Frequency Display Screen Glitches vs. Physical Hardware Damage*
- Example: "a vertical bright green line appeared on my screen without glass breakage"
- Gold: ESCALATE_COMPLEX vs. Predicted: AUTO_RESOLVE.
- **Hypothesis: The model assumes display issues are software-fixable unless words like "shattered" or "cracked" are explicitly present.
- Failure Mode 3: Sarcasm and Indirect Churn Risk Defusal*
- Example: "Thanks Apple for making my $1500 laptop a weighty paperweight after last night's breakage."
- Hypothesis: Positive sentiment lexical matches ("thanks") can skew routing away from ESCALATE_FRUSTRATED.
- Failure Mode 4: BM25 Shallow Retrieval Over-indexing on Generic Mac Update Terms*
- Hypothesis: The most frequent component in AppleSupport tweets is "update to iOS". BM25 requires dense semantic embedding to depreciate generic variations.
- Failure Mode 5: Over-Escalation on Generic Complaints (False Alarms)*
- Example: Users venting about the charger not being in the box were sometimes over-flagged as frustration escalations when they could be auto-resolved via Environmental Initiatives policy links.
- Survivorship Bias in Golden Dataset Stratification: The 93.5% intent accuracy and 72.8% escalation recall were benchmarked on 200 curated, well-formed stratified inquiries. Real-everyday Twitter data contains redhreads, incomplete garbled text, and multiple conflicting parallel issues in a single tweet.
- Escalation Recall vs. Precision Tradeoff: Our model achieves 86.8% precision with 72.8% recall. However, in Mission-Critical Customer Support, the 27.2% of missed escalations represent real customers with potentially leaked PII or thermally swollen batteries who received an auto-response instead of an immediate Senior Advisor.
- Static Historical Replies vs. Fluid Production KBs_ The agent's ROUGE-L score (0.201) is capped because historical brand resolutions vary by the diagnostic step taken. Similarity scores penalize valid alternative diagnostic questions.
- Selected @AppleSupport over Amazon/others: Apple has strict, stated federal/privacy-defined boundaries on public social channels, making escalation routing a first-class measurable spec rather than an arbitrary guess.
- Mandatory DM Escalation on PII: Detected cards/emails are never replied to with public diagnostics; agent routes to DM with an official Apple DM deep-link.
- Data-Derived 6-Class Taxonomy: Retired the 77-class Banking77 gramparent in favor of a practical operational 6-class set categorizing the actual issues tweeted at @AppleSupport.
- Two-Tier Escalation Router prior to LLM Reply Drafting: Safety and compliance rules run before generation, ensuring hazardous queries cannot hallucinate an auto-resolve.
- Stratified 200-Item Golden Eval Set: Ensured every intent has baseline samples, and balanced escalation conditions (45% escalation vs. 55% auto) to prevent class imbalance distortion.
- *Featuring False Alarm Rate (FAR): In customer support, over-escalation exhausts expensive human agents, so FAR was mandatorily tracked (7.6% achieved).
- *BM25 Hybrid over Pure Dense Embeddings: BM25 grounds actual apple.co links, menu paths ("Settings > Battery"), and model selections far better than uncalibrated vector cosine.
- Escalation First-class Reason Field: Agent must always provide
escalation_reasonto allow human audits to understand why it was routed. - Strict Brand Sign-off Enforcement: All generated replies must end with Apple's characteristic `c^[a-zA-Z]{2,3}`` sign-off to pass the judge rubric.
- Cohen's Kappa for Judge Calibration: Used Cohen's Kappa (rather than simple percentage) to prove the LLM judge actually has reliable attribution beyond random chance (0.6753).
- Avoided Full 3-Million Dataset Memory Ingestion: Subsampled the highest-quality solution threads to keep the repo runnable in < 15 minutes.
- Transparency on Reply-Metric Caveats: Revealed that ROUGE-L isolated is an imperfect proxy for support diagnostics, elevating the LLM-As-A-Judge score to 4.79 on human-aligned rubrics.
- *Harder Escalation on Lost Phone with 2FA: Account lockout with lost 2FA device always routes to Account Security Specialists due to severe identity verification complexity.
- Fully Reproducible Offline Harness: No binding external API latency factors in the reproducer; every headline metric can be verified deterministically in under 10 seconds.
- Integrate History-Aware Sequence Conversation State Machine: Parse multi-turn threads to track repeated service failures in the same thread and escalate after 2 unresolved turns.
- Hugging Face Sentence-Transformers Dense Vector Indexing: Upgrade to a dense hybrid index (Fiiss + BM25) for subtle paraphrased inquiries.
- Live Human-Agent Handoff Console UI (mini-Streamlit) dashboard: A dashboard where a support supervisor views auto-resolved queries vs. escalated tickets with provided `escalation_reason``.
- Fine-Tuning a Small Open Model (Llama-3-8b or Phi-3) on Apple Support Channel Tweets: Prevents using proprietary APIs for macro compliance.
- *Feature Factor Sensitivity Analysis:j Analyze how reply length and intent confidence scores correlate with escalation false alarms.
