An end-to-end engineering roadmap and practice repository covering mathematical foundations, big data engineering, classical machine learning, deep learning architectures, and production MLOps deployments.
Building real-world AI systems requires more than importing high-level frameworks. A production-ready Machine Learning Engineer must master:
- The Underlying Mathematics: Understanding vectors, gradients, loss surfaces, and statistical uncertainty to diagnose why models fail.
- Data & Systems Engineering: Parsing, cleaning, and transforming massive multi-modal datasets (tabular, images, hierarchical formats) reliably.
- Model Mastery: Choosing the right algorithm—from classical supervised/unsupervised baselines to modern Vision Transformers and YOLO architectures.
- Production Operations (MLOps): Exposing serialized weights via low-latency REST APIs (
FastAPI), isolating dependencies in containers (Docker), and automating delivery pipelines.
- 0.1 Linear Algebra for ML: Matrix/vector operations, dot products, matrix factorizations, eigenvalues/eigenvectors, and tensor representations in
NumPy. - 0.2 Multivariate Calculus: Partial derivatives, chain rule for computational graphs, gradients, Jacobians, and Hessians.
- 0.3 Probability & Statistics: Random variables, probability distributions (Gaussian, Bernoulli), Bayes' Theorem, Maximum Likelihood Estimation (MLE), hypothesis testing, and confidence intervals.
- 0.4 Optimization Theory: Convex functions, standard Gradient Descent, Stochastic Gradient Descent (SGD), Momentum, RMSProp, and Adam optimization mechanics.
- 1.1 Structured Ingestion: Query SQL databases and process large-scale CSVs using
pandasandPolars. - 1.2 Semi-Structured Parsing: Parse hierarchical API data (JSON/XML) into flat tabular structures.
- 1.3 Unstructured Handling: Load, normalize, and resize image datasets with
OpenCV/Pillow, managing bounding box.txtand.xmllabels. - 1.4 Feature Engineering: Handle missing values, encode categorical variables, and apply statistical scaling.
- 1.5 Pipeline Automation: Build reusable end-to-end preprocessing pipelines using
scikit-learnColumnTransformers.
- 2.1 Supervised Regression: Train and evaluate Linear Regression pipelines for continuous variable forecasting.
- 2.2 Supervised Classification: Implement Decision Trees, Random Forests, and XGBoost; evaluate using Precision, Recall, F1, and ROC-AUC.
- 2.3 Unsupervised Clustering: Apply K-Means and DBSCAN for pattern discovery and anomaly detection without labeled targets.
- 2.4 Dimensionality Reduction: Use PCA to reduce feature space complexity while retaining variance.
- 2.5 Reinforcement Learning: Train an autonomous Q-Learning / DQN agent in an OpenAI Gym simulation environment.
- 3.1 Foundations: Implement forward propagation, backpropagation, and optimization algorithms from scratch using pure Python/NumPy and PyTorch/TensorFlow.
- 3.2 Vision (CNNs): Train convolutional neural networks for image classification (ResNet / EfficientNet architectures).
- 3.3 Object Detection: Format datasets and train YOLO models for spatial bounding-box detection.
- 3.4 NLP (Transformers): Fine-tune pre-trained Transformer models (BERT) using Hugging Face for sequence classification.
- 4.1 REST API Serving: Build a high-performance inference microservice using
FastAPIandUvicorn. - 4.2 Input Validation: Ensure strict runtime data schemas using Pydantic models.
- 4.3 Containerization: Package the OS dependencies, Python runtime, and inference engine into a clean
Dockerfile. - 4.4 Orchestration: Configure
docker-compose.ymlfor multi-service deployment. - 4.5 Lifecycle Management: Implement experiment tracking and model artifact versioning (MLflow/CI-CD).
